🔍 Federated Learning: A New Approach to AI Training 🚀 Federated Learning is a revolutionary method for training AI models that prioritizes data privacy. 🛡️ It's a game -changer in the world of AI, turning the traditional machine learning process on its head. 📚 AI applications like chatbots, recommendation systems, and spam filters are data-hungry. Traditionally, we gather data from various sources and bring it to a central server for model training. But Federated Learning flips this process. Instead of bringing the data to the model, we take the model to the data. 🔄 📱 Imagine every device - a smartphone, laptop, or server - having its own local version of a model. Each model learns from the data right there on the device itself. After learning from the local data, it sends only the model updates back to the central server, not the actual raw data. The server then aggregates these updates from all devices to create a global model. 🌐 🔒 This decentralization was introduced by Google in 2016, amidst growing concerns about data privacy and security. It allows for collaborative learning from shared model updates while keeping the actual data distributed and private. 📈 For instance, a group of companies wanting to predict market trends can each train instances of the model using their sensitive sales data. They don't share their data, only the model updates. Over time, the model becomes increasingly accurate at predicting market trends, without any company having to share their sensitive data. 🎨 Federated Learning comes in three flavors: Horizontal (using similar datasets), Vertical (using complementary data), and Federated Transfer Learning (adapting a pre-trained model to do something slightly different). 🏥 The use cases are far-reaching, from healthcare to financial institutions. This is achieved through sophisticated algorithms that selectively erase traces of data without compromising the overall utility of the model. ⤴ Ronen Eldan (Microsoft Research) and Mark Russinovich (Microsoft Azure) presented in October 2023, a paper named "Who’s Harry Potter? Approximate Unlearning in LLMs", where they manifest that "unlearning, though challenging, is not an insurmountable task, as the positive outcomes in our experiments with the Llama2-7b model suggest." ⤵ In contrast, human memory is not a straightforward editable database. Our experiences, knowledge, and memories intertwine deeply with our emotions, making them irremovable and often defining our lifelong learning processes. 𝗦𝗼𝗺𝗲 𝗶𝗺𝗽𝗹𝗶𝗰𝗮𝘁𝗶𝗼𝗻𝘀: ☑ 𝘗𝘳𝘪𝘷𝘢𝘤𝘺 𝘢𝘯𝘥 𝘤𝘰𝘯𝘴𝘦𝘯𝘵: By selectively erasing data, we can better respect the privacy of individuals and comply with regulations like GDPR. However, ensuring that this process is transparent and consensual is crucial. ☑ 𝘉𝘪𝘢𝘴 𝘢𝘯𝘥 𝘧𝘢𝘪𝘳𝘯𝘦𝘴𝘴: Unlearning could help reduce biases in AI by removing problematic data. Yet, the choice of what gets unlearned could itself introduce new biases. Who decides what is unlearned, and based on what criteria? ☑ 𝘐𝘮𝘱𝘢𝘤𝘵 𝘰𝘯 𝘬𝘯𝘰𝘸𝘭𝘦𝘥𝘨𝘦: While removing data can protect privacy, it might also lead to a loss of valuable knowledge. Machine Unlearning VS Data Poisoning There is one very significant threat in AI security -> Data Poisoning. As we all know, once data is poisoned it's nearly impossible to clean the trained model. Even if you know Thai it happened and how it happened. The best thing you can do isto find your model backup (if you have it) 😜 but you will lose time and customers. Machine Unlearning is a relatively new field but already demonstrated some practical positive results. The unlearning literature can roughly be categorized into the following: 1. Exact unlearning 2. “Unlearning” via differential privacy 3. Empirical unlearning, where data to be unlearned are precisely known (training examples) 4. Empirical unlearning, where data to be unlearned are underspecified (think “knowledge”) 5.
